What is VimRAG
VimRAG is an omni-modal RAG framework open-sourced by the Alibaba Tongyi Lab, supporting image-text-video hybrid knowledge bases. The framework innovatively adopts a multimodal memory graph (DAG) to replace linear context, modeling reasoning as a dynamic directed acyclic graph to achieve traceable paths. VimRAG uses graph-guided policy optimization to precisely prune invalid paths and intelligently allocate visual tokens, solving cross-modal association breaks and state blind spots.
VimRAG's Main Features
-
Omni-Modal Knowledge Base Retrieval: Uniformly processes text, image, and video hybrid knowledge bases, supporting cross-modal content association and retrieval without the need to OCR videos into subtitles or build separate libraries.
-
Dynamic Memory Graph (DAG): Replaces linear context with a directed acyclic graph, where each node encapsulates "text summary + visual evidence + topological position," enabling traceable and trial-and-error reasoning paths.
-
Graph-Guided Policy Optimization (GGPO): Performs fine-grained contribution evaluation based on graph topology, automatically pruning invalid nodes (dead ends), retaining high-value retrieval paths, and reducing training gradient variance.
-
Intelligent Visual Energy Allocation: Dynamically allocates visual tokens based on node importance: core evidence retains high-definition images, while peripheral nodes are downgraded to text descriptions or directly pruned, saving compute.
-
Retrieval-Perception Decoupling: Separates "retrieval actions" from "visual perception," supporting progressive information acquisition from coarse to fine granularity and avoiding cross-modal association breaks.
-
Multi-Round Iterative Reasoning: The Agent can autonomously decide the next retrieval target (dig deeper into videos or go back to check text), avoiding repetitive query dead loops through branch trial and error.
VimRAG's Technical Principles
- Multimodal Memory Graph (DAG): Upgrades traditional linear context to a dynamic directed acyclic graph. Each node encapsulates "text summary + visual evidence + topological position," with the root node being the user query, generating reasoning paths through iterative expansion. The system supports branch trial and error, automatically marking redundant paths as dead ends, retaining key links, and thoroughly solving the "state blind spot" (forgetting already-retrieved content as context expands).
- Retrieval-Perception Decoupling: Separates the two stages of "thinking retrieval" and "visual perception." The Agent first decides the retrieval action (search, summarize, answer), then performs fine-grained perception on the returned multimodal content (region selection, cropping, scaling), achieving progressive information acquisition from coarse to fine granularity.
- Graph-Guided Policy Optimization (GGPO): Performs fine-grained contribution evaluation based on the memory graph topology. During training, it can precisely trace back: pruning non-contributing dead-end nodes in positive samples (masking gradients), and protecting effective retrieval nodes that did not answer correctly in negative samples (avoiding punishment). This significantly reduces gradient variance and accelerates policy convergence.
- Dynamic Allocation of Visual Energy: Calculates "energy values" based on node importance in the graph (topological out-degree, time decay, priority score). High-energy nodes retain complete visual tokens, while low-energy nodes are downgraded to sparse representations or plain text descriptions, carrying complete cross-modal understanding at extremely low computational cost.
How to Use VimRAG
- Quick API Experience: Call the Qwen3.5-Plus model via the Alibaba Cloud DashScope interface, configure the API Key, and launch the Streamlit interactive interface with one click to perform question answering in a preset image-text-video hybrid knowledge base.
- Local deployment (requires A100 80G VRAM): Deploy the Qwen2.5-VL-7B model locally and start the service via vLLM, while also starting the search engine API. Suitable for scenarios that require private deployment or custom models.
- Build a dedicated knowledge base: Organize images, PDFs (converted to images), and videos (split into segments) into a corpus; choose GVE or Qwen3-VL Embedding models to build a vector index; start the search service API, and connect the custom knowledge base to the VimRAG Agent to begin retrieval-based question answering.
Key information and usage requirements of VimRAG
- Product positioning: An omni-modal RAG framework open-sourced by Alibaba Tongyi Lab, designed for enterprise-grade mixed image, text, and video knowledge bases, and already integrated into Alibaba Cloud Bailian Knowledge Base.
- Core innovation: Uses a multimodal memory graph (DAG) instead of linear context, achieves fine-grained contribution evaluation through graph-guided policy optimization (GGPO), and with an intelligent visual energy allocation mechanism, solves cross-modal association breaks and the "state blind spot" problem.
- Performance metrics: In unified mixed-corpus testing, based on Qwen3-VL-8B, it achieves 50.1% average accuracy, significantly outperforming Vanilla RAG (37.6%) and ReAct (37.7%).
- Hardware environment: API mode requires no local GPU; local deployment requires NVIDIA A100 80G VRAM.
- Software dependencies: Python 3.10, and the dependency packages in requirements.txt need to be installed.
- Access credentials: Using API mode requires obtaining an Alibaba Cloud DashScope API Key in advance.
Core advantages of VimRAG
- Unified omni-modal processing: Natively supports mixed text, image, and video knowledge bases, without the need to OCR videos into subtitles or build separate databases, fundamentally solving the problem of cross-modal association breaks.
- Structured memory graph (DAG): Replaces linear context stacking with a dynamic directed acyclic graph. Each node encapsulates a text summary, visual evidence, and topological position, making reasoning paths traceable and trial-and-error possible.
- Graph-guided policy optimization (GGPO): Performs fine-grained contribution evaluation based on graph topology, automatically pruning invalid dead-end paths and protecting high-value nodes, significantly reducing training gradient variance and accelerating convergence.
- Intelligent visual energy allocation: Dynamically allocates visual tokens according to the importance of nodes in the reasoning topology. Core evidence retains high-definition images while edge nodes are downgraded to text, carrying the complete understanding process with extremely low token consumption.
- Decoupled retrieval-perception design: Separates the "retrieval action" and "visual perception" modules, supports progressive information acquisition from coarse to fine granularity, and completely eliminates the "state blind spot" and repeated-query infinite loop of traditional approaches.

Key information and usage requirements of VimRAG
| Comparison dimension | VimRAG | ReAct | MemAgent/Mem1 |
|---|---|---|---|
| Architecture design | Dynamic directed acyclic graph (DAG) structured topology | "Think-act-observe" linear pipeline | Memory mechanism but relatively shallow structure, relying on implicit learning |
| Context management | Nodes encapsulate text summaries + visual evidence + topological position, supporting path backtracking | Each step simply concatenates new content into the context, with no structural association | Linear or shallow memory management, lacking explicit topological relationships |
| Cross-modal processing | Explicitly modeling cross-modal associations, achieving cross-modal corroboration through graph structures | Prone to forgetting queried modalities and associations, resulting in "state blind spots" | Cross-modal associations rely on implicit model learning, with weak associativity |
| Training optimization | Graph-guided policy optimization (GGPO), fine-grained contribution evaluation, precise pruning of dead ends | No specific optimization mechanism, relies on end-to-end learning | One-size-fits-all rewards and penalties based on the final answer, with high gradient variance |
| Problem solving | Supports branch trial and error, automatically identifies and prunes invalid paths, avoiding repeated queries | Prone to falling into an infinite loop of repeatedly generating similar queries | Difficult to distinguish effective nodes for exploratory search versus conclusive verification |
Application scenarios of VimRAG
