R — Reading (direct quote from the source)

"Integrate all data into one central data warehouse... this is often the most important first step in AI transformation" — p18

I — Interpretation (restate in your own words)

Many companies' data is scattered across various business systems—one database for CRM, one for ERP, one for website logs, one for app data—isolated from each other and unable to form a combined force.

The Core Value of a Unified Data Warehouse:

  1. Break down data silos: Converge data scattered across systems onto one platform so the AI team can access the full set of data.
  2. Support the data flywheel: The flywheel requires continuous convergence of user behavior data; a unified warehouse is the flywheel's infrastructure.
  3. Avoid duplicate construction: Each business line doesn't need to build its own data pipeline; unified construction is more efficient.
  4. Ensure data consistency: One set of data definitions and standards avoids different departments having different numbers for the same metric.

Note: A unified data warehouse is along-term project, and may take 1-2 years to complete. Don't wait until the warehouse is perfect to start AI projects.

A1 — Past Application (past application cases)

  • Large retail enterprise: Integrated data from the online store, offline stores, supply chain, and customer service system into a unified data warehouse. The AI team built a demand forecasting model on this basis—if the data were still in isolated system silos, this model could not be trained at all, because it needs to use sales, inventory, and logistics data at the same time.

A2 — Future Trigger (future trigger conditions)

Trigger scenarios:

  • The AI team complains that "data can't be obtained" or "data is scattered everywhere"
  • The company wants to do AI but doesn't know where the data is
  • Different departments have different numbers for the same business metric
  • A data flywheel needs to be built but data convergence is the bottleneck

Language signals:

  • "data silos"
  • "data scattered"
  • "unified data"
  • "data warehouse"
  • "data convergence"
  • "data integration"
  • "data middle platform"

Key distinction: Use this framework when the bottleneck of the AI project isdata accessibility(the data exists but cannot be obtained).

E — Execution (execution steps)

  1. Inventory data assets: Sort out all of the company's data sources—business systems, logs, third-party data, etc.
  2. Design the data architecture: Determine the technology choices for the data warehouse (cloud data warehouses such as Snowflake/BigQuery, or self-built).
  3. Formulate data standards: Unify metric definitions, data formats, and naming conventions.
  4. Connect data sources in batches: Gradually connect each system's data to the warehouse by priority; there is no need to wait until everything is complete.
  5. Establish data governance: Clarify data ownership, access permissions, and quality responsibilities.
  6. Empower the AI team: Ensure the AI team can easily access and use the data in the warehouse.

Completion Criteria: Core business data has been integrated into the unified data warehouse, and the AI team can independently access the data needed to carry out modeling work.

B — Boundary (Boundary of Use)

Not Applicable Scenarios:

  • The company has only a single data source (no integration needed)
  • The data volume is extremely small (Excel is enough to manage it)
  • Urgent AI projects (cannot wait for the warehouse construction cycle)

Failure Modes:

  • Turning the data warehouse into a "data swamp" — data is all piled in but not governed, so it cannot be found or used
  • Pursuing big and comprehensive — trying to integrate all data at once, resulting in a project that never gets completed
  • Ignoring data security — a unified warehouse means greater security risk, and access control is essential

Author's Blind Spots:

  • Andrew Ng emphasized the importance of a unified warehouse, but did not fully discussthe contradiction between the construction cycle and the pace of AI projects— warehouse construction may take 1-2 years, but AI projects cannot wait that long. It is recommended to adopt a "build while using" strategy: first connect the most urgently needed data sources to launch AI projects, while continuing to improve the warehouse.

Related skills

  • data-flywheel — depends-on: The data flywheel requires a unified data warehouse as infrastructure to aggregate and manage the data generated by users; without a data warehouse, the flywheel is difficult to operate efficiently.
  • dont-wait-perfect-data — composes-with: A unified data warehouse is a long-term project, and AI projects should not wait until the warehouse is completed to start — the two work together to achieve "build while using".
